Learning Submodular Losses with the Lovasz Hinge

چکیده
Learning with non-modular losses is an important problem when sets of predictions are made simultaneously. The main tools for constructing convex surrogate loss functions for set prediction are margin rescaling and slack rescaling. In this work, we show that these strategies lead to tight convex surrogates iff the underlying loss function is increasing in the number of incorrect predictions. However, gradient or cutting-plane computation for these functions is NP-hard for nonsupermodular loss functions. We propose instead a novel convex surrogate loss function for submodular losses, the Lovász hinge, which leads to O(p log p) complexity with O(p) oracle accesses to the loss function to compute a gradient or cutting-plane. As a result, we have developed the first tractable convex surrogates in the literature for submodular losses. We demonstrate the utility of this novel convex surrogate through a real world image labeling task.

متن کاملUnsupervised Submodular Rank Aggregation on Score-based Permutations
Unsupervised rank aggregation on score-based permutations, which is widely used in many applications, has not been deeply explored yet. This work studies the use of submodular optimization for rank aggregation on score-based permutations in an unsupervised way. Specifically, we propose an unsupervised approach based on the Lovasz Bregman divergence for setting up linear structured convex and ne...
متن کاملConstrained Submodular Minimization for Missing Labels and Class Imbalance in Multi-label Learning
In multi-label learning, there are two main challenges: missing labels and class imbalance (CIB). The former assumes that only a partial set of labels are provided for each training instance while other labels are missing. CIB is observed from two perspectives: first, the number of negative labels of each instance is much larger than its positive labels; second, the rate of positive instances (...

متن کاملLearning classifiers with ternary weights Learning linear classifiers with ternary weights from Metagenomic Data
Motivated by recent researches in metagenomic classification tasks, this paper investigates the problem of finding interpretable concepts from training data in which the number of features is larger than the number of samples. In this setting, the classification problem is modeled as a combinatorial optimization problem, in which the aim of the learner is to find a {−1, 0, +1}-weighted linear t...
